You are not right – you would not find many a fish in deep waters. There are 4 depth zones, Littoral (up to 200 m), Neritic (200 m to 1000 m), Bathyal and Abyssal, of which Bathyal (1000 -2000 m) and Abyssal (>2000 m) are very thinly populated. In abyssal zone you will find only a few animals like Black swallower, tripod fish, deep-sea anglerfish, and the giant squid. They have special morphological arrangements to sustain a great water pressure. Most of the fishes, as well as other life forms, are restricted to the zones up to which sunlight penetrates. Namely, Littoral and Neritic Zones. Since the depths here is not very great (maximum 1000 m) fishes and other marine lives survive easily. And no, fishes, if brought from Littoral zone to shallower waters, do not burst out.
